Architecture Blueprint // System #05

Architecting AI Agents That Don’t Become Fragile or Unmaintainable

Moving beyond naive prompt chaining. How to engineer reliable, deterministic AI systems with structured JSON schemas, semantic caching, token budget guards, and circuit breakers.

The Real-World Context

Startups and enterprises frequently stitch together LangChain or complex autonomous agent scripts that hallucinate parameters, loop infinitely, drain API budgets, and fail unpredictably in production.

The Core Engineering Challenge

How to build production-grade AI applications where outputs are mathematically validated, tool execution is strictly sandboxed, and system behavior is deterministic and auditable.

Architectural Rationale & Trade-Offs

Evaluating failure modes, scaling bottlenecks, and defensive engineering decisions.

Decision 01 // Tech Stack

Why Finite State Machines (FSMs) instead of autonomous multi-agent loops?

Autonomous agent frameworks (like AutoGPT or naive LangChain agents) treat LLMs as universal decision-makers with free reign over loops. In production, this causes infinite recursion, hallucinated tool calls, and catastrophic token bills. By placing a deterministic Finite State Machine (FSM) around the LLM, the LLM is strictly restricted to making localized decisions within defined state boundaries.

Decision 02 // Tenancy & State Model

How do you guarantee valid JSON without parsing crashes?

Native LLM structured output modes paired with compile-time Zod schema validation. If the LLM generates an invalid payload, the error is caught deterministically by Zod, and a structured schema-correction prompt is executed with a hard cap of 2 retry attempts.

Decision 03 // Caching Layer

Where does caching live?

Two-tier caching: 1) Exact prompt hash caching in Redis for identical queries. 2) Semantic vector caching using embedding similarity (>0.96 cosine threshold) for recurring intent requests, cutting LLM inference costs by 40-60%.

Decision 04 // 10x Scale Behavior

What happens when LLM provider rates limit or experience latency spikes?

Automatic circuit breaker with multi-provider fallbacks. If OpenAI responds with a 429 rate limit or sub-5000ms latency degradation, the gateway immediately switches the inference call to Anthropic Claude 3.5 Sonnet or a self-hosted Mistral model.

Decision 05 // Third-Party Failure Modes

How do you prevent destructive database mutations from an AI hallucination?

The LLM is NEVER granted write access to a production database. AI agents only emit proposed mutation intents. Those intents are validated against business authorization policies and submitted to a human review queue or an automated deterministic verification engine.

The Most Critical Question // Architectural Restraint

What would I deliberately NOT build?

1) No bloated 15-library agent orchestration frameworks when 200 lines of robust TypeScript, strict Zod schemas, and standard fetch calls deliver higher reliability, 10x faster execution, and zero dependency vulnerability churn.
